Overview

This repository contains standalone Python implementations of five key AI optimization techniques:

  1. GELU Activation with Group Normalization - Stabilizing deep networks
  2. JIT-Fused Softmax - Kernel fusion for attention mechanisms
  3. Flash Attention - Memory-efficient attention computation

Each technique is implemented as a standalone script with comprehensive benchmarking, visualization, and detailed explanations of the underlying principles.

Optimization Techniques

1. GELU Activation with Group Normalization

File: gelu_groupnorm_demo.py

Key Benefits:

  • Improved training stability
  • Better gradient flow
  • Reduced internal covariate shift
  • Enhanced model convergence

Technical Details:

  • Group Normalization: Normalizes features within groups of channels, independent of batch size
  • GELU: Gaussian Error Linear Unit activation function, smoother than ReLU
  • Combination: Provides stable, expressive feature representations

Research Papers:

Usage:

python gelu_groupnorm_demo.py

2. JIT-Fused Softmax

Key Benefits:

  • O(n) memory complexity vs O(n²)
  • Faster computation for long sequences
  • Reduced memory usage
  • Better scalability

Technical Details:

  • Memory Efficiency: Avoids storing full attention matrix
  • Kernel Fusion: Optimized GPU kernels for attention computation
  • Scalability: Handles longer sequences efficiently

Research Papers:

Usage:

python flash_attention_demo.py

4. Winograd Convolution

File: winograd_convolution_demo.py

What it does: Implements Winograd convolution F(2x2, 3x3) as an alternative to standard convolution, reducing the number of multiplications required.

Key Benefits:

  • Fewer multiplications than standard convolution
  • Algorithmic optimization for small kernels
  • Potential speedup for specific kernel sizes
  • Maintains numerical accuracy

Technical Details:

  • Transformation Matrices: Pre-computed matrices for input/kernel/output transformation
  • Tile-based Processing: Divides input into overlapping tiles
  • Reduced Complexity: Fewer multiplications for small kernels

Research Papers:

Usage:

python winograd_convolution_demo.py

5. Stable Diffusion with xFormers

File: stable_diffusion_optimization_demo.py
